You’re scrolling through a streaming service, and it recommends a bizarre movie that seems completely random. Or maybe you apply for a new credit card and receive an instant, unexplained denial. We’ve all experienced the strange and opaque decisions made by AI systems. While a weird movie suggestion is harmless, the same opaque logic is now used to make life-altering decisions about loans, jobs, and even medical care. These algorithms increasingly act as gatekeepers to opportunities, yet they often operate as inscrutable “black boxes.”

To build trust, the tech industry has offered a solution: “Explainable AI” (XAI), a promise of transparency that lifts the lid on a model’s reasoning. But this promise often falls short. Many of these so-called “explanations” are not the clear, honest answers we think they are. Here are four surprising and concerning ways that AI transparency can be a dangerous illusion.

1. The Explanation Is Just an Educated Guess, Not Ground Truth

Many of the most common methods for explaining AI decisions, such as LIME (Local Interpretable Model-agnostic Explanations) or SHAP (SHapley Additive exPlanations), are what’s known as post-hoc techniques. This means they don’t reveal how the AI model actually works internally. Instead, after the AI has already made a decision, these tools work backward to create a simplified, approximate story of why that single outcome occurred. They essentially build a simple model to explain a complex one.

Organizations often choose these more complex ‘black box’ models because they are significantly more accurate, but that power comes at the cost of being able to explain how they work. Relying on post-hoc approximations gives users a false sense of understanding. The model’s true reasoning might be far more complex, or based on subtle, high-dimensional patterns that the simplified explanation misses entirely. The explanation isn’t the ground truth; it’s a plausible guess that fits the data. This creates a fundamental problem, as the AI isn’t really “reasoning” in a human sense at all.

The system cannot explain its reasoning because, in a meaningful sense, it does not reason. It identifies statistical patterns and applies them. The patterns may be valid, but they are not explanations.

2. You’re Getting a Convenient Story, Not the Whole Story

This deception goes a step further with “Proxy Explainability.” This is when an organization provides an explanation that sounds plausible and simple but doesn’t accurately reflect the AI’s complex decision-making process. It’s a convenient story designed to satisfy you, not to inform you.

For example, a credit company might tell a denied applicant that its decision was based on three simple factors like payment history, credit utilization, and length of credit history. In reality, its powerful machine learning model might be using hundreds of features in complex, nonlinear combinations. This is deeply problematic because it hides the real drivers behind the decision, preventing users from identifying potential errors or avenues for appeal. Crucially, it can also obscure systemic bias, where hidden features may be acting as proxies for protected characteristics like race or gender.

Proxy explainability is particularly problematic because it creates false confidence. Users believe they understand the system when they do not.

3. You’re Watching “Transparency Theater”

Some organizations engage in what can only be called “False Transparency,” performative acts designed to create the illusion of openness while obscuring the truth. This “transparency theater” takes several forms:

  • Overwhelming Disclosure: A company might publish thousands of pages of dense, technical documentation about its AI models. While technically transparent, it’s so voluminous and complex that no one can realistically read it or use it for accountability.
  • Selective Disclosure: An organization might publicly share the general architecture of its models while keeping the most critical details secret, such as the data it was trained on or the specific optimization goals the algorithm is designed to achieve.
  • Performative Governance: Companies may create high-profile AI ethics boards that have no real power to enforce changes or publish glossy “transparency reports” that are more public relations than substantive disclosure.

This kind of behavior is insidious. In the long term, it erodes public trust and makes people cynical, undermining the genuine efforts of others who are trying to achieve real transparency.

4. The Explanation Is Technically Correct, But Practically Useless

Finally, even a technically accurate explanation can be completely useless if it doesn’t meet the needs of the person receiving it. These “Explanation Gaps” are incredibly common and happen in a few key ways:

  • The Technical vs. Layperson Gap: A data scientist might receive an explanation stating that a loan was denied due to “high feature importance for variables X, Y, and Z.” This is technically correct but utterly meaningless to the applicant who needs to understand the decision.
  • The Individual vs. Systemic Gap: An explanation for a single decision might seem fair on its own while completely hiding a pattern of systemic bias. For example, a model might consistently deny loans to qualified applicants from a specific neighborhood, but the individual explanations would never reveal this broader, discriminatory pattern.
  • The Descriptive vs. Actionable Gap: An applicant might be told their loan was denied for “insufficient credit history.” This describes the problem, but it isn’t actionable. How much history is sufficient? What steps can they take to fix it? The explanation identifies a factor but provides no path forward.

This failure is common because building systems that provide truly helpful, actionable advice is much harder than simply exposing a few technical variables from a model. The result is an “explanation” that checks a box for the organization but leaves the affected person with no real answers.

Demanding Better Answers

Whether they are well-intentioned guesses, convenient fictions, or simply useless jargon, the ‘explanations’ we receive from AI often create an illusion of understanding rather than genuine transparency. Achieving real AI transparency isn’t just a marketing promise; it is a difficult and multifaceted design challenge that requires a commitment to providing answers that are not only accurate but also meaningful, complete, and actionable for the people they affect.

As AI makes more decisions that shape our lives, we must learn to ask not just for an explanation, but for the right one. The next time an algorithm tells you “why,” will you be able to tell if it’s the truth?
